Artificial intelligence adoption is surging. Business leaders are eager to deploy generative tools, automate workflows and cut costs. Yet many AI pilots and projects remain in limited release, with disconnected experiments draining budgets and stalling momentum. The issue isn’t a lack of ideas; it’s a lack of execution readiness.
We see five recurring gaps that stall AI pilots:
To address these deficiencies, scaling AI requires aligning strategy, governance, architecture and culture. Best practices include the following:
1. Establish strategy and a governance framework. An AI strategy should demonstrate a commitment to value, accountability and risk management. Establish governance within a structured framework, ensuring that policy maps to effective controls. The AI Risk Management Framework of the National Institute of Standards and Technology (NIST), the ISO/IEC 42001 standard, and similar guidelines offer practical playbooks to translate principles into daily practices. Leverage a strong framework to embed accountability, lifecycle discipline and oversight of AI use by third parties.
Regulation is shaping architecture choices, and the EU AI Act—which took effect Aug. 1, 2024—is one example with global impact. Its prohibitions and AI literacy obligations went into effect Feb. 2, 2025, and its rules for general-purpose AI models apply as of Aug. 2, 2025. Most of its remaining obligations take effect Aug. 2, 2026, with certain high-risk systems on longer timelines.
2. Build a reference architecture. Establish consistent standards for orchestration, AI model inference and system integration to help prevent shadow IT and support scalability. A shared reference architecture keeps teams aligned, prevents tool sprawl and accelerates reuse. Document integration patterns for commonly used platforms, define interoperability standards, and outline the desired system implementation path for teams. The goal is repeatability—reducing time to value and minimizing one-off stacks.
3. Advance data maturity. Move from spreadsheets to governed, trusted datasets. Focus on quality, lineage and accessibility within business-critical domains. Publish data products that AI can trust. Requirements for the age of AI include clear data ownership and stewardship with decision rights; management of reference data and master data as shared assets; access patterns that respect policy by default; and data quality targets tied to downstream model performance.
4. Operate AI as a value-tracked portfolio. Shift from isolated pilots to a tracked portfolio. Program-level portfolio rules should include use case ROI theses, baseline metrics, payback targets tied to specific stages, and predefined exit conditions or stop criteria. Product owners should be named across business, data development and risk functions. Benefits tracking allows for funding to follow evidence. Teams that meet gates and value targets receive more capacity, while others must pivot or stop. This rhythm accelerates learning and protects the budget.
5. Enable culture and talent. Skills matter, and so do roles and responsibilities. Train product owners, designers and AI engineers in prompt and agent design, model evaluation, privacy, security, and FinOps. An AI authority that maintains the reference architecture, publishes patterns, and supports teams can also equip the change management team so processes, incentives and training keep pace.
The cloud era has shown what happens when governance and strategy lag adoption. Duplicate spending, fragile systems and stalled ROI accelerate in tandem with scattered data and ever-increasing operating expenses. But AI moves even faster, with higher stakes. Without investing in readiness, enterprises risk repeating the same mistakes at a greater scale.
